9.2 Hands-On: A DPO Alignment Experiment

In Chapter 2, you already used DPO to teach a model to politely push back when a user is mistaken. That earlier run was mainly about "getting the pipeline to work". We did not look closely at what happens during training itself.

In this section we will use a slightly more demanding setup: aligning a model that tends to respond with sarcasm, and then watching every movement in the training metrics.

Preparing Preference Data

We will build a preference dataset that contains pairs of "sarcastic answers" and "polite answers". In each pair, ywy_w (chosen) is the polite, well-mannered answer, and yly_l (rejected) is the sarcastic one.

Notes on the code block above:

  1. The strings inside prompt/chosen/rejected are part of the dataset content. In practice you can keep them in Chinese or English; what matters is that the "chosen" completion is consistently preferable under the criterion you want to align to.
  2. We translate the surrounding explanation, and only translate clearly-explanatory print strings. We do not change the training semantics.

Running DPO Training

Next we load an instruction-tuned base model and run DPO training.

Analyzing the Training Process

After training, the DPO logs record several key metrics. Instead of treating them as opaque numbers, we should understand what each one is telling us.

Interpreting the Metrics

Training Loss. DPO uses a cross-entropy-like classification loss. If the loss starts near log20.693\log 2 \approx 0.693 (random guessing) and then decreases, the model is learning to separate good answers from bad answers.

Chosen Reward vs Rejected Reward. These "implicit rewards" are not scores from a separate reward model. They are derived from the policy probabilities:

A healthy training trend is:

  1. chosen reward increases (the model increasingly prefers good answers),
  2. rejected reward decreases (the model increasingly avoids bad answers),
  3. the gap between the two curves grows over time.

Reward Margin. This is the score gap between chosen and rejected. A larger margin means the model is separating them more confidently. If the margin stalls, typical causes are:

  1. β\beta is too large (the KL penalty anchors the policy too tightly to the reference),
  2. the preference data is noisy or inconsistent.

Reward Accuracy. On the training set, this is the fraction of pairs where the implicit reward ranks "chosen > rejected". It should rise from about 50% (random) toward 100%. But one warning is essential: accuracy near 100% does not imply the answers are actually good. It only says the model learned the preference ordering on this training set.

Sensitivity to β\beta

In DPO, β\beta is the key hyperparameter. It controls how far the policy is allowed to drift away from the reference model.

When β\beta is too small, it is like driving without a seatbelt: the model can chase the preference signal aggressively, but it may produce fluent yet nonsensical answers to "win" the objective. When β\beta is too large, it is like driving with the handbrake on: the policy wants to move, but the constraint prevents it, and you waste compute with little progress.

Exercise: If DPO's reward accuracy reaches 100% quickly, but human evaluation shows no improvement in answer quality, what might be happening?

One likely explanation is overfitting. The model may have memorized the preference pairs in the training set, without learning a general notion of what makes an answer good. Concretely:

  1. For prompts seen in training, the model can rank chosen above rejected almost perfectly.
  2. For new prompts, its behavior barely improves.

Common fixes include: collecting more diverse preference data, adding regularization, lowering the learning rate, and monitoring a validation set for generalization.

Another possibility is a subtle form of reward hacking. The model might latch onto superficial features (for example, longer answers or polite-sounding phrases) rather than genuinely improving correctness and helpfulness. This is hard to detect from metrics alone and often requires human evaluation or stronger automated evaluation.

Training metrics are only the surface. The real magic sits inside DPO's math: why can "changing the loss" remove the entire PPO loop? Why can we train without a separate reward model? For that, we need the derivation: DPO Theory and Variants.
